The Guiding Idea: Fine-Tuning in a Practical Way

Imagine this: your current original system is up and running, but you know it can benefit from contextual representation. That’s where fine-tuning comes into play. Fine-tuning allows you to bring in transformer representations in two different ways: simple featurization and full-on fine tuning.

The heart of this idea lies in extending the existing PyTorch modules from the course code distribution. By doing so, you can effortlessly create customized fine-tuning models with just a few lines of code. The ability to explore various designs and utilize these parameters to their fullest potential is truly empowering.

Simple Featurization: Taking a Step Back

Let’s start by rewinding to our discussion of recurrent neural networks (RNNs) and how we represent examples for those models. In the standard mode, we have examples represented as lists of tokens. These lists are then converted into lists of indices, which in turn help us look up vector representations of words in a fixed embedding space.

But here’s the exciting part: what if we could directly convert token sequences into lists of vectors using a powerful model like BERT? This would allow for contextual representation, where the same word can correspond to different vectors depending on its context. The model would then process lists of vectors as inputs.

Fine-Tuning for Added Benefits

Now, let’s take it a step further. We can go beyond simple featurization and actually update the BERT parameters, rather than just using them as frozen representations for inputs to another model. How do we do this? By subclassing the PyTorch modules included in our code distribution.

For instance, you can subclass the Torch Softmax Classifier and rewrite the build_graph function to specify a single dense layer. This way, the setup and optimization details are taken care of for you. Similarly, starting from the Torch Shallow Neural Classifier, you can rewrite the build_graph function to create a deeper model with more layers.

Go All the Way: BERT Fine-Tuning with Hugging Face Parameters

Now, are you ready for the star of the show? It’s time for BERT fine-tuning using Hugging Face parameters. Here’s how it works: we start with a PyTorch nn.module and load in a BERT module. By setting it to train mode, we can update its parameters.

The new parameters include a classifier layer, which is a dense layer tailored to the desired classification structure. The forward method calls the forward method of the BERT model, obtaining a range of representations. We can then use the Hugging Face Pooler Output, which captures parameters on top of the class token, as the input to the classifier.

When we optimize this model, not only will the classifier parameters be updated, but also all the parameters of the BERT model loaded in train mode. It’s like a whole new level of fine-tuning!

Unlocking Boundless Possibilities

So, my friends, you’ve seen the power of fine-tuning in natural language understanding. By customizing and extending existing modules, you can explore countless designs and make the most of these parameters for your specific problem.
